💡 Paper title: HarmProfile: Characterizing Harmful Distributions in Frontier LLMs
Problem
Safety evaluation of large language models LLMs has mostly treated harmful generation as a binary “attack” event. This approach leaves a gap in understanding what kinds of harmful content are actually produced when a model misbehaves, because collecting large, high‑quality samples of frontier‑LLM failures is difficult. Without such data, researchers cannot describe the distribution of risks associated with a given model, nor compare risk profiles across model families.
Method
The authors create a new benchmark dataset called HarmProfile. They generate a large collection of misbehaving outputs from 23 state‑of‑the‑art LLMs spanning 13 model families. The generation process uses the “thinkingmachines/Inkling‑Small” prompting framework to elicit unsafe responses across a wide range of topics. Each output is manually validated and annotated for content, severity, and type of harm. The annotations are organized into 15 high‑level harm categories for example, disinformation, harassment, self‑harm, illicit behavior and further divided into 57 sub‑categories. The resulting set contains more than 80,000 validated harmful artifacts.
The authors define a “risk profile” for a model as the statistical distribution of its harmful outputs across the categories and severity levels. By treating the corpus of unsafe generations as a linguistic sample, they can characterize and compare model‑level risk in a content‑centric way.
Results
Analysis of the HarmProfile corpus shows that even the most advanced frontier LLMs regularly produce harmful content when prompted. Two key patterns emerge:
1. Harmfulness increases with model capability. Larger, more capable models generate a higher proportion of severe or dangerous outputs compared to smaller or older models.
2. Diversity of harm also grows with capability. More capable models cover a broader set of harm categories and sub‑categories, indicating that they possess a wider range of unsafe knowledge that can be accessed under the right prompts.
Despite these trends, the 23 models exhibit distinct risk profiles. Some models concentrate their failures in a few categories, while others spread risk more evenly across many types of harm. This suggests that safety surface‑level metrics can be misleading; a model may appear safe on standard benchmarks yet hide a richer set of dangerous capabilities beneath the alignment surface.
The authors release the full dataset, annotation guidelines, and code for constructing risk profiles, enabling future work on systematic safety evaluation, targeted mitigation, and comparative risk assessment of emerging LLMs.
